Machine Learning

Machine Learning is the science of building systems that learn from data. This guide covers the core algorithms, model evaluation, feature engineering, and deployment patterns.

Machine learning is not a silver bullet - it is a powerful tool that requires careful problem framing, clean data, and rigorous evaluation. The choice of algorithm matters far less than the quality of the data and the clarity of the success metric.

Feature engineering remains one of the highest-leverage activities in applied ML. Domain knowledge translated into numeric signals consistently outperforms raw data fed into complex models. The best ML engineers are as comfortable at the data pipeline as they are at model selection.

Model deployment is where many ML projects stall. Serializing a model and wrapping it in a REST API is straightforward; building the monitoring infrastructure that detects drift, triggers retraining, and maintains performance over months in production is the hard part.

Understanding the bias-variance tradeoff and regularization deeply is what allows engineers to diagnose model failures quickly. Overfitting manifests in silent ways in production, making robust cross-validation and held-out test sets non-negotiable practices for any production ML system.

Logistic Regression Binary classification. Sigmoid output. Interpretable, fast baseline.

Decision Trees Split data by feature thresholds. Prone to overfitting. Interpretable.

Random Forest Ensemble of decision trees. Bagging reduces variance. Robust, handles missing data.

Gradient Boosting (XGBoost, LightGBM, CatBoost) Sequential tree ensemble. Often wins structured data competitions.

Support Vector Machines (SVM) Find hyperplane maximizing margin. Kernel trick for non-linear boundaries.

K-Nearest Neighbors (KNN) Non-parametric, distance-based. Simple but slow at inference.

Naive Bayes Probabilistic classifier. Fast, works well with text data.

2Unsupervised Learning

K-Means Clustering Partition into k clusters by minimizing intra-cluster variance. Sensitive to initialization.

DBSCAN Density-based clustering. Handles noise and arbitrary shapes. No need to specify k.

Hierarchical Clustering Build dendrogram of nested clusters. Agglomerative (bottom-up) or divisive.

PCA (Principal Component Analysis) Reduce dimensionality by projecting to principal components (directions of max variance).

t-SNE / UMAP Non-linear dimensionality reduction for visualization. UMAP is faster and preserves more structure.

Autoencoders Neural network that learns compressed representation (latent space) for reconstruction.

    Anomaly Detection
  • Isolation Forest: randomly isolate anomalies via short paths in random trees
  • One-Class SVM: define boundary around normal data
  • Statistical methods: z-score, IQR

3Model Evaluation & Selection

    Bias-Variance Tradeoff
  • High bias = underfitting (too simple model)
  • High variance = overfitting (model memorizes training data)
  • Goal: find sweet spot via regularization, cross-validation
    Cross-Validation
  • k-Fold CV: split data into k parts, train on k-1, validate on 1, rotate
  • Stratified k-Fold: preserve class distribution in each fold
  • Leave-One-Out (LOO): extreme case, expensive

Metrics Cheat Sheet | Task | Metric | Formula | |---|---|---| | Regression | MAE | mean(|y - ŷ|) | | Regression | RMSE | √mean((y - ŷ)²) | | Classification | Accuracy | correct / total | | Classification | F1 | 2 × (P×R)/(P+R) | | Classification | AUC-ROC | area under ROC curve | | Ranking | NDCG | normalized discounted cumulative gain |

Confusion Matrix TP, FP, TN, FN foundation for precision and recall.
